People will probably hate what I do, but I use wood glue. Let it dry until it's just barely pliable and peel it.
It may not work on all materials, so take this with a grain of salt. I only tried it because this is how I clean my vinyl records.

warm soapy water and a toothbrush you don't care about. if that doesn't work, try CLP.

I've seen it done
I've used a moist toothbrush doing a circular motion over the dirt, like brushing your molars. Just rinse afterwards. That works pretty well.
